Abstract
The accelerating wave of digital transformation and artificial intelligence has become a defining force of the Fourth Industrial Revolution, reshaping social and economic systems worldwide. In this context—marked by population aging, declining birth rates, and post-pandemic disruptions—lifelong learning has emerged as a national imperative. Unlike prior studies limited to participation status or partial outcomes, this research integrates machine learning and explainable artificial intelligence (XAI) to uncover the latent determinants of non-formal learning effectiveness and to propose a data-driven framework for personalized learning recommendation. Employing multiple models across distinct datasets for training, validation, and latent groups, CatBoost achieved the highest accuracy in the training phase (99.01%), while XGBoost yielded the best validation performance (92.13%). SHAP-based interpretability revealed that learning effectiveness depends less on how much one learns than on why and how one learns. Key positive drivers—learning orientation, life satisfaction, social connectedness, career motivation, and informational accessibility—contrasted with negative contributions from external financial support and long participation duration, emphasizing intrinsic engagement over extrinsic conditions. Among 12,514 non-participants, 63.31 % were predicted to form a high-effectiveness group, validating the policy relevance of personalized recommendations. Temporal shifts in variable importance further caution against rigidly applying past decision rules to evolving learner populations. The study concludes by proposing an adaptive lifelong-learning roadmap that integrates data governance, privacy protection, digital-divide reduction, and localized co-governance, paving the way toward a sustainable and inclusive learning ecosystem powered by explainable AI.
