Abstract
This study presents a stacking-based artificial intelligence model designed to predict the unloading time of quay crane (QC) operations at Busan Port. The unloading time is influenced by complex factors, including internal elements like crane travel distance, container positioning (BAY–ROW–TIER), and job sequencing, as well as external conditions such as weather. To account for these multifaceted influences, we create a variety of regression models—Linear Regression, Random Forest, SVR, XGBoost, CatBoost, and MLP—serving as base learners, and utilize an MLP as the meta-model within a stacking ensemble framework. We utilize actual QC operation logs to establish both QC-specific (Local) and integrated (Global) datasets for training and evaluation, with Mean Absolute Error (MAE) as the primary performance metric. Experimental results indicate that the Local stacking model reduces the average MAE by over 60% compared to individual models, consistently improving performance across all QCs. Although the Global model exhibits a slightly higher absolute error, it effectively captures common patterns across different QCs, showcasing strong generalization capabilities. Ablation studies on weather and spatial movement variables confirm the critical importance of both feature groups in enhancing predictive performance. Overall, the proposed stacking model offers a practical and robust framework for predictive analytics, supporting operational planning and decision-making in real port environments.
