Abstract
This study proposes a deep learning model for water leakage detection in water distribution networks (WDNs), whichenhances feature representation by transforming 1D frequency signals into 2D images and employing a ConvolutionalNeural Network (CNN), specifically EfficientNet-B0. Utilizing the public AI Hub Water Pipeline Leakage Detection dataset, our approach addresses the representational limitations of conventional tree-based ensemble models. We augment thestandard cross-entropy loss by incorporating advanced metric learning techniques, namely Supervised Contrastive Loss(SCL) and Angular Triplet Loss. These methods explicitly structure the embedding space by maximizing intra-classcompactness and inter-class separability, thereby improving the model’s discriminative power and generalizationcapabilities. Experimental results demonstrate that the proposed model with SCL outperforms the state-of-the-art Light-GBM model across all standard metrics, including accuracy and precision. Notably, the significant improvement inprecision indicates a reduced false alarm rate, which is critical for practical applications. Furthermore, we validate thequality of the learned representations through both qualitative t-SNE visualization and quantitative k-NN classificationon the embedding space, confirming the model’s reliability and the geometric soundness of its feature manifold.
